When deactivating View -> Layout -> Toolbar, the toolbar should not appear on the composer window. Alternatively, a different control might be set under the View menu in the composer window.

it's a window on its own, in the composer there is no view -> layout for a good reason.

A simple View -> Toolbar could be used then.
